Good old Elmer glue!

Good old Elmer PVA glue! Not as cheap as in store during the school supplies sale, but very convenient for delivery. Good price online.

Not just for kids

I've learned to restore/repair old plaster frames and good old Elmers is one of the ingredients, works like a charm! I also restored an old vintage chest to use as a jewelry box and I used Elmers paint (diluted slightly with water) to "paint" to keep the felt in place, right on top of that wood glued. It comes off easily enough if you get it wrong, but holds tight if you don't. It is also very useful for restoring old paper labels stuck to the back of antiques to keep for the next custodian.
